چکیده

Many applications require recovering a ground truth low-rank matrix from noisy observations of the entries. In practice, this is typically formulated as a weighted low-rank approximation problem and solved using non-convex optimization heuristics such as alternating minimization. Such non-convex techniques have few guarantees. Even worse, weighted low-rank approximation is NP-hard for even the most simple case when the ground truth is a rank-1 matrix. Under moderate assumptions on the weight matrix and the ground truth, we prove that the vanilla alternating minimization algorithm with a simple and cheap ”clipping” step, which zeroes out rows with high l2 norms norms in the intermediate solutions, recovers the ground truth. In particular, we bound the spectral norm of the difference between the recovered matrix and the ground truth, by the spectral norm of the weighted noise plus an additive error term that decreases exponentially with the number of rounds of alternating minimization. This provides the first recovery guarantee for weighted low-rank approximation via alternating minimization with non-binary deterministic weights. It is a significant generalization of the results for matrix completion, the special case with binary weights, since our assumptions are similar or weaker than those made in existing works. Additionally, our proof applies for random initialization, unlike prior approaches that typically require an SVD-based initialization. Tighter Low-rank Approximation via Sampling the Leveraged Element

In this work, we propose a new randomized algorithm for computing a low-rank approximation to a given matrix. Taking an approach different from existing literature, our method first involves a specific biased sampling, with an element being chosen based on the leverage scores of its row and column, and then involves weighted alternating minimization over the factored form of the intended low-ra...

Uniqueness Conditions For Low-Rank Matrix Recovery

Low-rank matrix recovery addresses the problem of recovering an unknown low-rank matrix from few linear measurements. Nuclear-norm minimization is a tractable approach with a recent surge of strong theoretical backing. Analagous to the theory of compressed sensing, these results have required random measurements. For example, m ≥ Cnr Gaussian measurements are sufficient to recover any rank-r n ...

Bridge the Gap Between Group Sparse Coding and Rank Minimization via Adaptive Dictionary Learning

Both sparse coding and rank minimization have led to great successes in various image processing tasks. Though the underlying principles of these two approaches are similar, no theory is available to demonstrate the correspondence. In this paper, starting by designing an adaptive dictionary for each group of image patches, we analyze the sparsity of image patches in each group using the rank mi...

Recovery of signals under the high order RIP condition via prior support information

In this paper we study the recovery conditions of weighted l1 minimization for signal reconstruction from incomplete linear measurements when partial prior support information is available. We obtain that a high order RIP condition can guarantee stable and robust recovery of signals in bounded l2 and Dantzig selector noise settings. Meanwhile, we not only prove that the sufficient recovery cond...
